Private Posts Still Show in Categories

In WordPress, when creating a post, I can set the publishing option to private. The problem is, even though it hides the post elsewhere, in the category view it’s still present. Like the tagged categories have their own taxonomy (which I can’t access) and this category is just showing everything published (regardless of private status). Was is the private option not hiding it so only those with a direct link can view it?
